🔖Brief Introduction

We present ARTrack, an autoregressive framework for visual object tracking. ARTrack tackles tracking as a coordinate sequence interpretation task that estimates object trajectories progressively, where the current estimate is induced by previous states and in turn affects subsequences. This time-autoregressive approach models the sequential evolution of trajectories to keep tracing the object across frames, making it superior to existing template matching based trackers that only consider the per-frame localization accuracy. ARTrack is simple and direct, eliminating customized localization heads and post-processings. Despite its simplicity, ARTrack achieves state-of-the-art performance on prevailing benchmark datasets.

🔖Inference Speed

Our baseline model (backbone: ViT-B, resolution: 256x256) can run at 26 fps (frames per second) on a single NVIDIA GeForce RTX 3090, our alter decoder version can run at 45 fps on a single NVIDIA GeForce RTX 3090.

Bug of array of inhomogeneous shape

Thanks to MrtXue, if you meet the "ValueError: setting an array element with a sequence." when you train in the second stage, you can try to reduce your numpy version to 1.23.

Install the environment

Use the Anaconda (CUDA 11.3)

conda env create -f ARTrack_env_cuda113.yaml

Set project paths

Run the following command to set paths for this project

python tracking/create_default_local_file.py --workspace_dir . --data_dir ./data --save_dir ./output

After running this command, you can also modify paths by editing these two files

Data Preparation

Put the tracking datasets in ./data. It should look like this:

Training

Download pre-trained MAE ViT-Base weights and put it under $PROJECT_ROOT$/pretrained_models (different pretrained models can also be used, see MAE for more details).

One-stage pair-level training

Since sequence-level training requires video input, and the COCO dataset contains only images, traditional training methods were first used to train the model so that it could be fairly compared to other trackers.

python tracking/train.py --script artrack --config artrack_256_full --save_dir ./output --mode multiple --nproc_per_node 4 --use_wandb 0

Replace --config with the desired model config under experiments/artrack. We use wandb to record detailed training logs, in case you don't want to use wandb, set --use_wandb 0.

Two-stage sequence-level training

To enable sequence-level training, replace 'experience/artrack_seq/*.yaml' PRETRAIN_PTH in the yaml configuration file with the path to your pretrained checkpoint, such as './output/artrack_256_full/checkpoints/train/artrack/artrack_256_full/ARTrack_ep0240.pth.tar'.

Evaluation

Change the corresponding values of lib/test/evaluation/local.py to the actual benchmark saving paths

Where is SIoU

Hello, I would like to ask you where the part of SIoU involved in the paper is in the code. I found IoU and gIoU in the code, but I didn't see much about SIoU

ValueError: The number of weights does not match the population

First of all, great thank to your fantastic job.

I followed your tutorial to start training on LaSOT only, however after loading pre-trained [MAE ViT-Base weights] form (https://dl.fbaipublicfiles.com/mae/pretrain/mae_pretrain_vit_base.pth), it seems that the network couldn't match the code.

Do I need to trace down the network .py file to find the difference?

About the implementation details of ARTrackV2

Hi, thanks for your inspiring work! I am trying to reimplement ARTrackV2 for my recent project. I've encountered some uncertainties regarding certain implementation details. I'm hoping you could provide some guidance on the following points:

  1. Identity embedding. I'm curious about how identity embedding is handled within ARTrackV2. Specifically, are different identity embeddings assigned for appearance tokens, confidence tokens, and trajectory tokens? Additionally, is the identity token used for trajectories the same as the command token?
  2. Appearance tokens. Could you shed some light on the length of appearance tokens? Are they expected to be of the same length as the template?
  3. Positional Embedding. I'm interested in understanding how positional embedding is initialized for appearance tokens, confidence tokens, trajectory tokens, and command tokens in the second stage of training (sequence-level training).
  4. Model structure of the reconstruction decoder. It would be helpful to have insights into the model structure of the reconstruction decoder. Specifically, details such as the number of layers, number of heads, etc.

Additionally, given that the code cannot be made public in recent future, would it be possible for you to share training logs or intermediate results (such as accuracy of the frame-level pretrain model) to assist us in validating our implementation?

Checkpoints for evaluation on new test sets

Is there a checkpoint I can use off-the-shelf to evaluate on a new car tracking test set I have?

In other words, do you have a checkpoint you expect to work well on new datasets? Or is it recommended to train my own model on car tracking training data?

Can ARTrack predict when no object is present?

I have video sequences where objects come in and out of frame. If I include every frame of the video in the Sequence object, ARTrack predicts a bounding box for every frame. Can ARTrack predict when the template object is not present? How would I implement that?

1.我查了一些关于单目标跟踪的数据集,有Lasot,Got10k,trackingnet,otb,uav123,vot等等。然后看到有些人说otb,uav123数据集只作测试用不会用作训练,我查了一些还是不确定具体的规则,所以请教一下作者大大这方面的知识。
2.看了一些关于单目标跟踪的代码,那个数据准备部分的示例(你放了lasot,got10k,coco,trackingnet),这是指多个不同的数据集一起训练吗?(如果一起训练的话,测试指标是怎么算的呢?)
3.还有就是你的配置文件,比如artrack_256_full.yaml 与artrack_256_got.yaml, 这两个区别是指第一个用3个数据集一起训练,第二只用got训练吗?

Reproducing paper results - second training stage loss reaches a noisy plateau very early

Hi,
We are trying to reproduce your results.
During the training of the second stage, we observe unusual behavior in both loss components, which become noisy and flat after a few epochs.
In addition, we are unable to reach the results you published in the paper. For example, following exactly the same settings you used for training, ARTrack256 on LaSOT demonstrated an AUC and precision that were 1.3% and 1.4% lower, respectively, compared to the results you reported.

Did you encounter a similar loss behavior during your training?

I attached the graphs showing the losses we observed in the second training stage.

About Focal Loss Weight (balancing parameter)

Hello, I was looking your amazing work and happened to find something strange about the loss balancing parameters.

In script, artrack_seq.py.
Line #213 seems to assign loss balancing weight for the Cross-entropy Loss. However, the value is set to 0.

In order to reproduce your work, might the value supposed to be changed to 1, since the GIoU weight is already set to 2.0 in the artrack_seq_256_full.yaml script?

Basically, I wanted to know if the code handles a video instead of datasets. Indeed, I'd like to try running the pretrained model on a 4K video to measure the inference time as well as the performance, to compare with other models. Thus, I wondered if this was possible and if so how ?
